Multimodal hate meme detection based on fusion of causal mask control and counterfactual intervention mechanism

Abstract

Hateful memes function as emerging vectors of violence in social media, deriving semantic depth from socio-cultural contexts. This inherent complexity poses core challenges to content safety governance. Existing research prioritized shallow modality optimization while neglecting causal dependencies in semantic alignment, resulting in cross-modal semantic deviations. To address this gap, the current work proposes a multimodal hate detection framework integrating Causal Mask Control and Counterfactual Intervention mechanisms. The model employs visual-textual encoding followed by a Causal Mask Control module for explicit cross-modal dependency modeling. Further integrated Counterfactual Intervention Mechanism masks critical feature units, quantifies prediction probability shifts, and identifies causal pathway nodes for hate propagation. This process generates counterfactual semantic deviation vectors to adaptively recalibrate attention weights based on contextual semantics. Experimental results demonstrate F1 scores of 71.8% on MUTE and 68.8% on MultiOFF datasets. The framework effectively mitigates spurious correlations between background noise and hate semantics, significantly enhancing detection accuracy compared to established baselines.
